Available in PDF, EPUB and Kindle. Book excerpt: The non-volatile memory technique advanced rapidly in recent years. First, mature NAND flash memory is getting cheaper and denser. It has impacted our daily life. Second, emerging persistent memory technologies such as 3d XPoint have demonstrated great potentials in revolutionizing modern memory hierarchy. In this research, we first carry out a project on the mature NAND-flash-based solid state drives. We propose a new RAID5 technique called CR5M to enhance data reliability within a single SSD for safety-critical mobile applications. We also proposed an associated data reconstruction strategy called MCR to further shrink the window of vulnerability. Compared with traditional RAID5, CR5M can achieve up to 40.2% performance improvement. The data recovery speed is also improved by 7.5%. Because persistent memory is byte-addressable and has near-DRAM access speed, it exhibits a huge potential to build a hybrid memory system where both DRAM and PM are directly connected to a CPU. We designed a concurrent hash-assisted radix tree for DRAM-PM Hybrid Memory Systems. In such a system, an efficient indexing data structure such as a persistent tree becomes an indispensable component. Designing a capable persistent tree, however, is challenging as it has to ensure consistency, persistence, and scalability without substantially degrading performance. We propose a novel concurrent and persistent tree called HART (Hash-assisted ART), which employs a hash table to manage ARTs. HART not only optimize its performance but also prevent persistent memory leaks. In most cases, HART significantly outperforms WOART and FPTree, two state-of-the-art persistent trees. Also, it scales well in concurrent scenarios. Then, we proposed multi-hashing, a dual-level hash table indexing for a highperformance, large-capacity, and low-cost in-memory database. Multi-hashing is also built on a DRAM-PM hybrid memory system. On the DRAM level, an indexing structure is designed to be memory-efficient to manage hot indexes. On the PM level, another indexing data structure is designed to be performance-optimized. The indexes in DRAM will be merged into PM periodically. Our experimental results show that multi-hashing shows better performance under Sparse workloads when compared with HART. It also consumes less memory under both Dense and Sparse workloads.

The advent of NVM will fundamentally change the dichotomy between volatile memory and durable storage in DBMSs. These new NVM devices are almost as fast as volatile memory, but all writes to them are persistent even after power loss. Existing DBMSs are unable to take full advantage of this technology because their internal architectures are predicated on the assumption that memory is volatile. With NVM, many of the components of legacy DBMSs are unnecessary and will degrade the performance of data-intensive applications. We present the design and implementation of DBMS architectures that are explicitly tailored for NVM. The book focuses on three aspects of a DBMS: (1) logging and recovery, (2) storage and buffer management, and (3) indexing. First, we present a logging and recovery protocol that enables the DBMS to support near-instantaneous recovery. Second, we propose a storage engine architecture and buffer management policy that leverages the durability and byte-addressability properties of NVM to reduce data duplication and data migration. Third, the book presents the design of a range index tailored for NVM that is latch-free yet simple to implement. All together, the work described in this book illustrates that rethinking the fundamental algorithms and data structures employed in a DBMS for NVM improves performance and availability, reduces operational cost, and simplifies software development.

Book excerpt: Driven by the growing demands from big-data applications, the focus of their data management has been largely shifted from traditional SQL databases to NoSQL (Not-only SQL) databases, such as key-value (KV) stores, which provides essential functionalities and much higher performance for storing and retrieving data. Correspondingly new hardware technologies have been developed to support the fast data accesses, such as NVMe SSDs and Infiniband network. However, existing designs of NoSQL databases usually see sub-optimal performance on fast hardware. Traditionally the computing overhead of a database system is overshadowed by the slow storage and network. With the adoption of the new hardware technologies the inefficiency at the software side is now the major source of bottlenecks in today's systems.In this dissertation we propose solutions to overcome barriers on the adoption of new technologies, such as large DRAMs, fast SSDs, and low-latency Infiniband network, into existing stacks of software systems. Accordingly introduce new designs, including Search Lookaside Buffer (SLB), zExapnder, LSM-trie, and NVM cached, to improve the systems'efficiency on accessing SSD, DRAM, non-volatile main memory, and CPU cache. We identify false temporal locality and false spatial locality in index search and propose SLB to effectively improve index search by removing the false localities. In zExpander we use compression to increase the effective capacity in KV caches without adding DRAM, which can substantially reduce misses in the KV cache. In LSM-trie we introduce a trie-based data structure to reduce the overhead of internal data reorganization by an order of magnitude for KV stores on SSDs. In NVM cached we remove expansive FLUSH operations for persistent and crash-consistent KV caches on byte-addressable NVM.

Book excerpt: Data-intensive applications like databases, recommender systems, and key-value caches, typically consume a large amount of DRAM in order to provide high-performance operations. However, DRAM is a relatively expensive storage medium that is facing major scaling challenges. Storage technologies such as Non-Volatile Memory (NVM) and flash can potentially be a lower-cost alternative to DRAM, but introduce several challenges due to their limited read and write bandwidth, higher latency, and limited endurance. This dissertation focuses on how to exploit the application properties to mask these challenges. It provides the design and implementation of three novel and practical data-store systems that significantly reduce the DRAM footprint by utilizing various methods to overcome the device limitations. We present MyNVM, a SQL database that reduces DRAM usage by leveraging NVM as a second level cache, while providing comparable latency and queries-per-second (QPS) as MyRocks on a server with a much larger amount of DRAM. It introduces novel solutions to the challenges of replacing DRAM with NVM, including using small block sizes with a partitioned index, aligning blocks post-compression to reduce read bandwidth, utilizing dictionary compression, implementing an admission control policy, as well as replacing interrupts with a hybrid polling mechanism. Unfortunately, Using NVM solely as a cache may not be sufficient for highly performance-sensitive applications such as real-time recommender systems. We present Bandana, a storage system for deep learning models that uses NVM as the primary storage medium. Typical large-scale recommender systems use deep learning models that are stored on a large amount of DRAM and rely on embeddings, which consume most of the required memory. The main challenge in storing embeddings on NVM is its limited read bandwidth compared to DRAM. Bandana uses two primary techniques to address this limitation: first, it stores embedding vectors that are likely to be read together in the same physical location, using hypergraph partitioning, and second, it decides the number of embedding vectors to cache in DRAM by simulating dozens of small caches. These techniques allow Bandana to increase the effective read bandwidth of NVM by 2-3× and thereby significantly reduce the total cost of ownership. Even when providing sufficient performance, the adoption of NVM and flash has been limited in write-heavy use cases due to their limited durability. Key-value caches, for example, need to frequently insert, update and evict small objects. This causes excessive writes and erasures on flash storage, which significantly shortens the lifetime of flash. We present Flashield, a hybrid key-value cache that uses DRAM as a filter to control and limit writes to flash. Flashield performs lightweight machine learning admission control to predict which objects are likely to be read frequently without getting updated. These objects, which are prime candidates to be stored on flash, are written to flash in large chunks sequentially. In order to efficiently utilize the cache's available memory, Flashield utilizes a novel in-memory index for the variable-sized objects stored on flash that requires only 4 bytes per object in DRAM. Compared to state-of-the-art systems that suffer a write amplification of 2.5× or more, Flashield maintains a median write amplification of 0.5× (since many filtered objects are never written to flash at all), without any loss of hit rate or throughput.
