Such is the case at Aisin Manufacturing Illinois where this study will be testing the use of convolutional neural networks (CNNs) to classify paint defects on painted outside door handles and caps for automobiles. Widespread implementation of vision systems has resulted in advancements in machine learning. As the field of artificial intelligence (AI) evolves and improvement are made, diverse industries are adopting AI models for use in their applications. Medical imaging classification using neural networks has exploded in recent years. Convolutional neural networks have proven to scale very well for image classification models by extracting various features from the images. A goal of this study is to create a low-cost machine learning model that is able to quickly classify paint defects in order to identify rework parts that can be repaired and shipped. The central thesis of this doctoral work is to test a machine learning model that can classify the paint defects based on a very small dataset of images, where the images are taken with a smartphone camera in a manufacturing setting. The end goal is to train the model for an overall accuracy rate of at least 80%. By using transfer learning and balancing the class datasets, the model was trained to achieve an overall accuracy rate of 82%.

Book excerpt: Quality control is a fundamental component of many manufacturing processes, especially those involving casting or welding. However, manual quality control procedures are often time-consuming and error-prone. In order to meet the growing demand for high-quality products, the use of intelligent visual inspection systems is becoming essential in production lines. Recently, Convolutional Neural Networks (CNNs) have shown outstanding performance in both image classification and localization tasks. In this article, a system is proposed for the identification of casting defects in X-ray images, based on the Mask Region-based CNN architecture. The proposed defect detection system simultaneously performs defect detection and segmentation on input images, making it suitable for a range of defect detection tasks. It is shown that training the network to simultaneously perform defect detection and defect instance segmentation results in a higher defect detection accuracy than training on defect detection alone. Transfer learning is leveraged to reduce the training data demands and increase the prediction accuracy of the trained model. More specifically, the model is first trained with two large, openly available image datasets before fine-tuning on a relatively small metal casting X-ray dataset. The accuracy of the trained model exceeds the state-of-the art performance of the Grupo de Inteligencia de Máquina database of X-ray images (GDXray) Castings dataset and is fast enough to be used in a production setting. The system also performs well on the GDXray Welds dataset. A number of in-depth studies are conducted to explore how transfer learning, multitask learning, and multi-class learning influence the performance of the trained system.

Book excerpt: The objective of this thesis is to study the application of deep learning in seed image classification using convolutional neural networks. The images are captured using an unmanned aerial vehicle as might be used in a plant breeding program. Plant breeding programs extensively monitor the evolution of seed kernels for seed certification, wherein lies the need to appropriately label the seed kernels by type and quality. However, the breeding environments are large where the monitoring of seed kernels can be challenging due to the relatively small size of seed kernels. For this experiment, we use an unpiloted aerial vehicle to capture images at low altitude while being able to access even the remotest areas in the environments. In a small breeding program, they might use fixed cameras instead. A key bottleneck in the labelling of seeds using UAV imagery is drone altitude, i.e., the classification accuracy decreases as drone altitude increases due to lower image detail. Convolutional neural networks are a great tool for multi-class image classification where there is a training dataset that closely represents the different scenarios that the network might encounter during evaluation. However, with the seeds being in a breeder environment coupled with the varying image resolution and clarity, it is challenging to generate a training dataset that covers all possible evaluation scenario. This work addresses the challenge of training data creation using Domain Randomization wherein synthetic image datasets are generated from a meager sample of seed images captured by the bottom camera of an autonomously driven Parrot AR Drone 2.0. Also, the work includes a seed classification framework as a proof-of-concept using the convolutional neural networks of Microsoft's ResNet-100, Oxford's VGG-16, and VGG-19. To enhance the classification accuracy of the framework, an ensemble model is developed resulting in an overall accuracy of 94.6%. The task of classification is performed on five distinct types of seeds, canola, rough rice, sorghum, soy, and wheat. The second use case is the drones are used for aerial surveying where the UAV imagery is used to estimate the area of a plot. The work demonstrates how the area can be calculated using the pixels of an image and the camera specifications of the drone.
