Although considerable progress has been made, widespread adoption of AVs will not become a reality until solutions are developed that enable AVs to co-exist with Human-driven Vehicles (HVs). There are still many challenges preventing Connected and Autonomous Vehicles (CAVs) from safely and smoothly navigating. We identify two major challenges in this direction. First, the communication system is not always reliable and suffers from noise and information loss. Second, AV navigation in the presence of HVs is challenging, as HVs continuously update their policies in response to AVs and the social preferences and behaviors of human drivers are unknown. Towards this end, we first propose solutions to improve situational awareness by enabling reliable and robust Cooperative Vehicle Safety (CVS) systems that mitigate the effect of information loss and propose a hybrid learning-based predictive modeling technique for CVS systems. Our prediction system is based on a Hybrid Gaussian Process (HGP) approach that provides accurate vehicle trajectory predictions to compensate for information loss. We use offline real-world data to learn a finite bank of driver models that represent the joint dynamics of the vehicle and the driver's behavior. AVs and HVs equipped with such reliable vehicular communication can coordinate, improving safety and efficiency. However, even in the presence of perfect communication, is still challenging for CAVs to navigate in the presence of humans. Therefore, we study the cooperative maneuver planning problem in a mixed autonomy environment. We frame the mixed-autonomy problem as a Multi-Agent Reinforcement Learning (MARL) problem and propose an approach that allows AVs to learn the decision-making of HVs implicitly from experience, account for all vehicles' interests, and safely adapt to other traffic situations. In contrast with existing works, we quantify AVs' social preferences and propose a distributed reward structure that introduces altruism into their decision-making process, allowing the altruistic AVs to learn to establish coalitions and influence the behavior of HVs. Inspired by humans, we provide our AVs with the capability of anticipating future states and leveraging prediction in the MARL decision-making framework. We propose the integration of two essential components of AVs, i.e, social navigation and prediction, and present a prediction-aware planning and social-aware optimization RL framework. Our proposed framework take advantage of a Hybrid Predictive Network (HPN) that anticipates future observations. The HPN is used in a multi-step prediction chain to compute a window of predicted future observations to be used by the Value Function Network (VFN). Finally, a safe VFN is trained to optimize a social utility using a sequence of previous and predicted observations, and a safety prioritizer is used to leverage the predictions to mask the unsafe actions, constraining the RL policy. The experiments on real-world and simulated data demonstrated the performance improvement of the proposed solutions in both safety and traffic-level metrics and validate the advantages and applicability of our solutions.

This includes safely and efficiently interacting with human-driven vehicles, especially in both conflictive and competitive scenarios. Despite the advances in the autonomous driving domain, autonomous vehicles (AVs) are still inefficient and limited in terms of cooperating with each other or coordinating with vehicles operated by humans. A prerequisite for realizing this inter-agent coordination is creating an effective and reliable means of communication among agents that enables them to share their situational awareness and constitute a mass intelligence. Cellular Vehicle-to-everything (C-V2X) communication is introduced to address the latency and reliability requirements of cooperative safety applications. Such applications can involve highly congested vehicular scenarios where the network experiences high data loads. I investigate the reliability of these vehicular networks and propose a framework that enables them to scale to large groups of vehicles. A group of autonomous and human-driven vehicles (HVs) that are equipped with such reliable vehicular communication can work together to optimize an altruistic social utility --as opposed to the egoistic individual utility-- and co-exist seamlessly. Achieving this mission without explicit coordination among agents is challenging, mainly due to the difficulty of predicting the behavior of humans with heterogeneous preferences in mixed-autonomy environments. Formally, I model an AV’s maneuver planning in mixed-autonomy traffic as a partially-observable stochastic game and attempt to derive optimal policies that lead to socially-desirable outcomes using a multi-agent reinforcement learning framework. I build up on the prior work on socially-aware navigation and borrow the concept of social value orientation from psychology --that formalizes how much importance a person allocates to the welfare of others-- in order to induce altruistic behavior in autonomous driving. In contrast with existing works that explicitly model the behavior of human drivers and rely on their expected response to create opportunities for cooperation, the Sympathetic Cooperative Driving (SymCoDrive) paradigm trains altruistic agents that realize safe and smooth traffic flow in competitive driving scenarios only from experiential learning and without any explicit coordination. I demonstrate a significant improvement in both safety and traffic-level metrics as a result of this altruistic behavior and importantly conclude that the level of altruism in agents requires proper tuning as agents that are too altruistic also lead to sub-optimal traffic flow.

To achieve these goals, we propose taking a human-centered approach to ease the transition into human-dominated fields. In this work, our modeling methods and control schemes are validated through user studies in a realistic motion simulator and demonstrate improved interaction, predictability, and trustworthiness. Autonomous vehicles are a great motivating example, due to the wealth of interesting problems that arise with human-in-the-loop control and multi-agent interaction and cooperation. While autonomous vehicles will likely be publicly available soon, it can be assumed that the transition will not be instantaneous, suggesting that: (1) levels of autonomy will be introduced incrementally, and (2) autonomous vehicles will have to be capable of driving in a mixed environment, with both humans and autonomy. In both cases, the human drivers must be modeled in an accurate and precise manner that easily integrates into control frameworks. We present a data-driven approach to hybrid system tools, that approximates the forward reachable set of a coupled human-robot system. This empirical reachable set is an alternative look at a classic control theoretic safety metric and allows us to predict driver behavior over long time horizons in a robust, yet informative, manner. This method is compared to an extension of traditional reachability, in which the optimal disturbances are uncovered using empirical metrics with probabilistic guarantees. Applications of this work include the design of minimally invasive intervention schemes for semi-autonomous vehicles and of planning nuanced interactions between humans and autonomy in interactive maneuvers. We also consider concerns that arise with shared control. Given a fixed semi-autonomous framework, we model the communication between the human and automation using information theory metrics. By controlling information flow, we observe an information/performance trade-off that follows a strongly concave relationship. This is formulated as an optimization paradigm, giving a model-based approach to interface design for optimizing interaction.
