This thesis focuses on the problems of human pose estimation in still images or video, including the diversity of appearances, changes in scene illumination and confounding background clutter. To tackle these problems, we build a robust model consisting of the following components. First, the top-down and bottom-up methods are combined to estimation human pose. We extend the Pictorial Structure (PS) model to cooperate with annealed particle filter (APF) for robust multi-view pose estimation. Second, we propose an upper body based multiple mixture parts (MMP) model for human pose estimation that contains two stages. In the pre-estimation stage, there are three steps: upper body detection, model category estimation for upper body, and full model selection for pose estimation. In the estimation stage, we address the problem of a variety of human poses and activities. Finally, a Deep Convolutional Neural Network (DCNN) is introduced for human pose estimation. A Local Multi-Resolution Convolutional Neural Network (LMR-CNN) is proposed to learn the representation for each body part. Moreover, a LMR-CNN based hierarchical model is defined to meet the structural complexity of limb parts. The experimental results demonstrate the effectiveness of the proposed model.

In particular, humans are very good at recognizing various objects in the scene and understanding different activities that the people in the scene are engaged in. In this thesis, we tackle the fundamental problem of detecting people and understanding their pose, which is a prerequisite towards high level scene understanding and human activity recognition. Unlike previous work which manually decompose human body into anatomical parts (i.e. head, torso, arms, legs) with a family of warped (i.e. rotated and foreshortened) templates modeling each part, the thesis proposes a novel technique that models human pose with a mixture of small non- oriented parts based on a new representation of deformable part models. The model is general and flexible enough to capture spatial relationships between part locations and co- occurrence relations between part mixtures, augmenting standard pictorial structure models that encode just spatial relations. We show superior empirical performance on a set of experimental results on standard benchmarks that suggest our approach is the state-of-the- art system for pose estimation, improving past work on several benchmark datasets, while being orders of magnitude faster. We also show several interesting applications based on human detection and pose estimation, including human interaction recognition and semantic image segmentation where we also provide promising results, suggesting our approach is fundamental and superior.

This approach is based on a bottom up parsing technique which uses a non-parametric representation known as Greedy Part Association Vector (GPAVs), generates features for localizing anatomical key points for individuals. Taking leaf out of existing state of the art algorithm, this proposed algorithm aims to estimate human pose in real time and optimize its results. This approach simultaneously detects the key points on human body and associates them by learning the global context. However, In order to operate this in real environment where noise is prevalent, systematic sensors error and temporarily crowded public could pose a challenge, an efficient and robust recognition would be crucial. The proposed architecture involves a greedy bottom up parsing that maintains high accuracy while achieving real time performance irrespective of the number of people in the image.

Book excerpt: Outside the factory, robots will often encounter mechanical systems with which they need to interact. The robot may need to open and unload a kitchen dishwasher or move around heavy construction equipment. Many of the mechanical systems encountered can be described as a series of rigid segments connected by joints. The pose of a segment places constraints on adjacent segments because they are mechanically 'connected. When modeling or perceiving the motion of such an articulated system, it is beneficial to make use of these constraints to reduce uncertainty. In this thesis, we examine two aspects of perception related to articulated structures. First, we examine the special case of a single segment and recover the rigid body transformation between two sensors mounted on it. Second, we consider the task of tracking the configuration of a multi-segment structure, given some knowledge of its kinematics. First, we develop an algorithm to recover the rigid body transformation, or extrinsic calibration, between two sensors on a link of a mobile robot. The single link, a degenerate articulated object, is often encountered in practice. The algorithm requires only a set of sensor observations made as the robot moves along a suitable path. Over-parametrization of poses avoids degeneracies and the corresponding Lie algebra enables noise projection to and from the over-parametrized space. We demonstrate and validate the end-to-end calibration procedure, achieving Cramer-Rao Lower Bounds. The parameters are accurate to millimeters and milliradians in the case of planar LIDARs data and about 1 cm and 1 degree for 6-DOF RGB-D cameras. Second, we develop a particle filter to track an articulated object. Unlike most previous work, the algorithm accepts a kinematic description as input and is not specific to a particular object. A potentially incomplete series of observations of the object's links are used to form an on-line estimate of the object's configuration (i.e., the pose of one link and the joint positions). The particle filter does not require a reliable state transition model, since observations are incorporated during particle proposal. Noise is modeled in the observation space, an over-parametrization of the state space, reducing the dependency on the kinematic description. We compare our method to several alternative implementations and demonstrate lower tracking error for fixed observation noise.

Having the position and orientation of every member of a human being can lead to extract higher level information such as the type of action being performed or the identification of unsafe positions. The proposed algorithm is based on a widely used method called Iterative Closest Point and uses three-dimensional data. The algorithm developed in the project, called Constrained Articulated-ICP, is a variant of this method. It is adapted to the articulated properties of a human body. Several techniques have hence been developed in order to improve the pose recognition, as well as to ensure its validity. A human model is created and the orientation of every member is found by iterative matchings. The pose information is then directly extracted thanks to this model. Developing the algorithm for a real-time application, the pose tracking proved to be accurate and stable. The performed evaluation highlights its ability to recognise the human pose in motion and while performing everyday life movements such as sitting or walking.

Book excerpt: In this thesis, we investigate ways of enabling intelligent systems to recognize human desires and wants, and we devise systems that automatically recover human pose and gesture information. We place special emphasis on applications for improving the safety and comfort of vehicles. We present a novel method for learning and tracking the pose of an articulated body by observing only its volumetric reconstruction from images. The model is called the kinematically constrained Gaussian mixture model (kc-gmm). Pairs of components connected at a joint are encouraged to assume a particular spatial configuration, forming joints with 1, 2 or 3 degrees-of-freedom (DOF). Pose learning is based on the EM algorithm, and is the first to be evaluated using a common human image data-set with optical motion capture ground-truth. The algorithm achieved estimates with mean joint position error of 15.9cm, or 8% of the total length of the body. On synthesized hand data, the error was 0.5cm, or 1.5% of the total length. Next, we present results on the characterization and recognition of driver intent using driver gestural cues. The concepts apply towards the study of other driving maneuvers. The data-driven pattern classification approach makes use of vehicle dynamics information and driver head and hand pose information via an optical motion capture system. We present results comparing different combinations of input cues. We proposed a novel visualization of results to analyze the classifiers: ROC Area vs. Decision Time and Statistical Response Over Time plots. Driver-intent recognition algorithm above assumes the use of body part position information. We present an in-vehicle system for detecting and tracking the position of the left and right hands in long-wavelength infrared imagery. The results were effective in tracking hands over 90 minutes of driving. Combined with steering information, 5 hand activities over the steering wheel could also be determined. Finally, we present an in-vehicle system for determining which occupant is accessing the vehicle infotainment controls for modulating information flow from the vehicle's information display. The average correct classification rate of 97.8% was achieved over 60 minutes of 30fps video under a variety of moving vehicle operating conditions.
