An increase in the number of robots allows one to achieve different kind of tasks by exploiting cooperation, such as: robot swarms, object manipulation using multiple degrees of freedom of different robots. It is quite challenging for the human operator to coordinate multiple robots to achieve a task in an efficient manner. The channels available to receive feedback information from the robot system can vary from simple encoder reading to video stream acquisition of the robot system performing tasks. It is important for us to make use of and coordinate as many sensing modalities as it is required to perform necessary tasks. On the other hand, we would want to keep the number of modalities utilized optimal just to maintain usage intuitiveness for human operators and efficiency. In this dissertation, we have investigated 3 different modalities of interaction with robots. Physical sensing: we present a novel approach to enhance human-robot interactivity through the use of artificial skin and the Extended Kalman filter. Visual sensing: we present a novel approach to enhance interaction of humanoid robot actor through the use of pose estimation and visual servoing. Interface devices: we present a work on combining dynamic gestures based commands from an interface device to improve the intuitiveness of control / planning of multiple degrees of freedom robot system through reinforcement learning. We propose an efficient way to coordinate multiple modalities sensing as generalized interface for multiple robots manipulation / planning. In addition, performance metrics are proposed so that we have the quantitative way to identify our interaction efficiency. Eventually, the outcome of this research is a reconfigurable multiple interfaces system that can be used with different multiple robots system in a way that it is easy and intuitive for the human operator to learn to operate.

Some of these challenges include complex social interaction, safety, identifying human intent, unpredictable physical interaction, and uncertain dynamic environments. The focus of this research is safe, robust, and intuitive physical interaction with humans utilizing multiple sensor modalities. In this dissertation, a solution for adaptive physical human-robot interaction is proposed. The proposed framework consists of three parts. Dynamics compensation: adaptive dynamics compensation is proposed and extended to control complex, nonlinear, and constantly changing robotic systems. Adaptive force control: adaptive inverse control techniques are utilized to develop an admittance control system to compensate for changing task, sensor, and human conditions during interaction. Human motion study: Dynamic time warping is utilized as a method for movement characterization and dynamic movement primitives are used to develop a scalable and adaptable movement representation system. The proposed framework was inspired by the structure of the human motor cortex and somatosensory systems. An inner-loop control structure performs the function of the lower level fast dynamic compensation system while an outer-loop adaptive force controller enables task, sensor, and human specific control. This type of controller can adapt to the changing dynamics of the robot as well as compensate for the changing environmental sensing capacity and interaction scenario

Book excerpt: In recent years, researchers have achieved great success in guaranteeing safety in human-robot interaction, yielding a new generation of robots that can work with humans in close proximity, known as collaborative robots (cobots). However, due to the lack of ability to understand and coordinate with their human partners, the ``co'' in most cobots still refers to ``coexistence'' rather than ``collaboration''. This thesis aims to develop an adaptive learning and control framework with a novel physical and data-driven approach towards a real collaborative robot. The first part focuses on online human motion prediction. A comprehensive study on various motion prediction techniques is presented, including their scope of application, accuracy in different time scales, and implementation complexity. Based on this study, a hybrid approach that combines physically well-understood models with data-driven learning techniques is proposed and validated through a motion data set. The second part addresses interaction control in human-robot collaboration. An adaptive impedance control scheme with human reference estimation is presented. Reinforcement learning is used to find optimal control parameters to minimize a task-orient cost function without fully knowing the system dynamic. The proposed framework is experimentally validated through two benchmark applications for human-robot collaboration: object handover and cooperative object handling. Results show that the robot can provide reliable online human motion prediction, react early to human motion variation, make proactive contributions to physical collaborations, and behave compliantly in response to human forces.

In the 19th century E.J. Marey and E. Muybridge introduced chronophotography to scientifically investigate animal and human movements. They opened the field of motion analysis by being the first scientists to correlate ground reaction forces with kinetics. Despite of the apparent simplicity of a given skilled movement, the organization of the underlying neuro-musculo-skeletal system remains unknown. A reason is the redundancy of the motor system: a given action can be realized by different muscle and joint activity patterns, and the same underlying activity may give rise to several movements. After the pioneering work of N. Bernstein in the 60’s on the existence of motor synergies, numerous researchers «walking on the border» of their disciplines tend to discover laws and principles underlying the human motions and how the brain reduces the redundancy of the system. These synergies represent the fundamental building blocks composing complex movements. In robotics, researchers face the same redundancy and complexity challenges as the researchers in life sciences. This book gathers works of roboticists and researchers in biomechanics in order to promote an interdisciplinary research on anthropomorphic systems at large and on humanoid robotics in particular.

Among these methods, learning from demonstrations (LfD) enables robots to effectively and efficiently acquire skills by learning from human demonstrators, such that a robot can be quickly programmed to perform a new task. This book introduces recent results on the development of advanced LfD-based learning and control approaches to improve the robot dexterous manipulation. First, there's an introduction to the simulation tools and robot platforms used in the authors' research. In order to enable a robot learning of human-like adaptive skills, the book explains how to transfer a human user’s arm variable stiffness to the robot, based on the online estimation from the muscle electromyography (EMG). Next, the motion and impedance profiles can be both modelled by dynamical movement primitives such that both of them can be planned and generalized for new tasks. Furthermore, the book introduces how to learn the correlation between signals collected from demonstration, i.e., motion trajectory, stiffness profile estimated from EMG and interaction force, using statistical models such as hidden semi-Markov model and Gaussian Mixture Regression. Several widely used human-robot interaction interfaces (such as motion capture-based teleoperation) are presented, which allow a human user to interact with a robot and transfer movements to it in both simulation and real-word environments. Finally, improved performance of robot manipulation resulted from neural network enhanced control strategies is presented. Much of the research within the book is based on the Human Research and Engineering Directorate (HRED), U.S. Army Research Laboratory (ARL) 5-year Army Technology Objective (ATO) research program. The program addressed HRI and teaming for both aerial and ground robotic assets in conjunction with the U.S. Army Tank and Automotive Research and Development Center (TARDEC) and the Aviation and Missile Development Center (AMRDEC) The purpose of the program was to understand HRI issues in order to develop and evaluate technologies to improve HRI battlefield performance for Future Combat Systems (FCS). The work within this volume goes beyond the research results to encapsulate the ATO's findings and discuss them in a broader context in order to understand both their military and civilian implications. For this reason, scientists conducting related research have contributed additional chapters to widen the scope of the original research boundaries.
