Not only should the sensors be informative, but they should also be able to communicate efficiently. In this paper, we present a data-driven approach that addresses the three central aspects of this problem: measuring the predictive quality of a set of sensor locations (regardless of whether sensors are ever placed at these locations), predicting the communication cost involved with these placements, and designing an algorithm with provable quality guarantees that optimizes the NP-hard tradeoff. Specifically, we use data from a pilot deployment to build non-parametric probabilistic models called Gaussian Processes (GPs) both for the spatial phenomena of interest and for the spatial variability of link qualities, which allows us to estimate predictive power and communication cost of unsensed locations. Surprisingly, uncertainty in the representation of link qualities plays an important role in estimating communication costs. Using these models, we present a novel, polynomial-time, data-driven algorithm, pSPIEL, which selects Sensor Placements at Informative and cost-Effective Locations. Our approach exploits two important properties of this problem: submodularity, formalizing the intuition that adding a node to a small deployment can help more than adding a node to a large deployment; and locality, under which nodes that are far from each other provide almost independent information. Exploiting these properties, we prove strong approximation guarantees for our pSPIEL approach. We also provide extensive experimental validation of this practical approach on several real-world placement problems, and built a complete system implementation on 46 Tmote Sky motes, demonstrating significant advantages over existing methods."

To avoid strong assumptions, such as fixed sensing radii, and to tackle noisy measurements, Gaussian processes (GPs) are often used to model the underlying phenomena. A commonly used placement strategy is to select the locations that have highest entropy with respect to the GP model. Unfortunately, this criterion is indirect, since prediction quality for unsensed positions is not considered, and thus suboptimal positions are often selected. In this paper, we propose a mutual information criterion that chooses sensor locations that most reduce uncertainty about unsensed locations. We first show that choosing a set of k sensors that maximizes the mutual information is NP-complete. By exploiting the submodularity of mutual information we propose a polynomial-time algorithm that guarantees a placement within (1 - 1/[epsilon]) of the maxima. This algorithm is extended to exploit local structure in the Gaussian process, significantly improving performance. Finally, we show that the sensor placements chosen by our algorithm can lead to significantly better predictions through extensive experimental validation on two real-world datasets."

There are several common strategies to address this task, for example, geometry or disk models, placing sensors at the points of highest entropy (variance) in the GP model, and A-, D-, or E-optimal design. In this paper, we tackle the combinatorial optimization problem of maximizing the mutual information between the chosen locations and the locations which are not selected. We prove that the problem of finding the configuration that maximizes mutual information is NP-complete. To address this issue, we describe a polynomial-time approximation that is within (1 - 1/e) of the optimum by exploiting the submodularity of mutual information. We also show how submodularity can be used to obtain online bounds, and design branch and bound search procedures. We then extend our algorithm to exploit lazy evaluations and local structure in the GP, yielding significant speedups. We also extend our approach to find placements which are robust against node failures and uncertainties in the model. These extensions are again associated with rigorous theoretical approximation guarantees, exploiting the submodularity of the objective function. We demonstrate the advantages of our approach towards optimizing mutual information in a very extensive empirical study on two real-world data sets."

Thus, significant downsampling is necessary, but determining the best locations for optimal full-state reconstructions is an NP-hard problem. Solving for the optimal sensor selections would require the researcher to test all (n/p) combinations of placing p sensors given n possible locations, which is only feasible for very small systems. Instead, researchers have developed techniques to calculate near-optimal sensor placements, usually based on convex relaxations or greedy algorithms. This text focuses on a well-known greedy algorithm, the column-pivoted QR decomposition, which is performed on basis modes from a low-rank decomposition of the system, to pick out sensor locations that are approximately maximally informative and robust to noise. The column-pivoted QR decomposition is efficient and has proven optimality guarantees, but it does not account for several important practical considerations, including sensor cost, purpose, and type. In this work, we extend the QR decomposition to account for some of these real-world constraints. First, we modify the algorithm to account for a heterogeneous cost function on sensor location, selecting sensors that are approximately Pareto optimal in cost and reconstruction quality. Next, we demonstrate that the cost-constrained column-pivoted QR decomposition can be applied to modal bases beyond the most common basis of singular vectors. In this way, we can select sensors and actuators for control systems, account for a system's estimated equations of motion, and even select sensors without training data. Finally, we approach the problem of multi-fidelity sensor selection, that is, determining where and how many of each type of sensor to place, given a fixed budget and access to cheap, high-noise sensors and expensive, low-noise sensors. This problem is complex and has a very large parameter space, but we develop guidelines for asymptotic cases of sensor cost and noise level. The above methods are demonstrated on examples from physics, climate science, and facial recognition, showing that it is possible to improve sensor effectiveness and decrease cost by considering real-world practicalities.
