Book excerpt: Inspired by human perception, novel research into the sub-domain of robotic perception, known as extended object tracking, is presented. This research is motivated by the practical challenges of deploying robot driven cars (aka robocars, self-driving cars, autonomous road vehicles, etc.) into the existing transportation infrastructure alongside human-controlled vehicles. In this vein, arbitrary, uncooperative extended objects maneuvering in close proximity to the ego vehicle are considered, without a priori knowledge of the environment (e.g. road structure, traffic laws, etc.) or the objects to be tracked (e.g. controls, intent, shape, size, type, etc.). The novel approaches presented here are primarily aimed at improving the precision and accuracy of extended object tracking by mitigating the inherent information loss associated with interpreting sensor data returned from arbitrary extended objects. Specifically, a rigorous probabilistic occlusion model is derived for identifying and fusing negative information inherently present in sensor data; information that is heavily leveraged by humans, but largely ignored by robots. Further, a rigorous estimation framework is proposed for estimating the detailed shape of extended objects jointly with their kinematics; detailed object shape estimates enable explicit sensor models, which, in turn, engender improved tracking precision. Additionally, a hierarchical tracking framework is proposed for dynamically allocating computational resources in proportion to an objects continuously changing relevance to the ego robot task, as defined by novel probabilistic object relevancy metrics. As a result, at any given time, objects considered to be of central importance to the ego robot task are tracked with relatively complex, high-precision methods, while objects deemed merely peripheral to the ego robot task are tracked with relatively low complexity, low precision methods; a direct analog to the human concepts of attention and focus in allocating finite cognitive resources. The proposed work is evaluated via simulation and experiments involving Cornell University's autonomous Chevy Tahoe, Skynet, demonstrating that non-traditional sensor models are necessary for high precision tracking of arbitrary extended objects, and that humans are worth emulating en route to this goal.

Book excerpt: Tracking capacity is typically defined by a limitation of 3-4 objects, suggesting that there may be a structural constraint on attentional resources for tracking (Pylyshyn & Storm, 1988). In this view, tracking capacity is item limited and the amount of resources allocated to each object is fixed. However, studies have found that tracking limits can be extended to 8 or more objects with appropriate reductions in velocity (Alvarez and Franconeri, 2007). Contrary to the discrete resource account, these findings suggest that tracking may depend on a continuous limited-capacity system in which a finite resource is divided among tracked objects in varying amounts, depending on tracking difficulty. The present set of experiments examined the nature of the resource limitations observed in multiple object tracking. ☐ The continuous resource model posits that participants can only increase the number of objects tracked by reducing the amount of resource allocated to each tracked object with accompanying reductions in the spatial precision of tracking. This prediction was evaluated using a novel version of the MOT task in conjunction with a mixture model to obtain separate estimates of the number of objects tracked and tracking precision as the number of objects to-be-tracked was varied between 1 and 6. The results showed marked individual differences at high tracking loads, where half of the participants tracked only a few targets with high precision while the remaining half tracked many targets with low precision. Experiment 2 explored whether these individual differences reflected fixed differences in the underlying tracking architecture or different strategies that could be freely adopted by any observer. Participants were instructed and incentivized to maximize the number of objects tracked at the expense of precision to determine whether tracking performance is flexible to strategy. Many but not all observers were able to flexibly trade off precision in favor of a larger number of tracked targets. These results are consistent with models that point to a limited resource whose allocation is flexibly determined by tracking demands. ☐ The flexibility of attention allocation was further tested in Experiment 3 to examine whether resources can be endogenously varied between targets. High priority targets were tracked with greater precision than low priority targets, indicating that differential amounts of attention could be distributed between tracked objects. Experiment 4 examined whether tracking resources are hemifield specific or if a common pool is shared across visual fields. Although tracking two objects was just as precise as tracking a single object when they were presented bilaterally, distractors were more likely to be mistaken for tracked objects with increased set size regardless of spatial arrangement. The results support a bilateral advantage in tracking, but not independence. Experiment 5 investigated whether people attend to all tracked objects simultaneously or if each object is attended serially. ERPs were used to measure online processing of task-relevant probes on moving objects. Consistent with a parallel account, probes occurring on tracked objects were processed with no delay regardless of the number of objects tracked, while probes on distractor objects were processed with significant delays. ☐ In summary, these results are consistent with continuous resource models that assume that tracking additional objects is accompanied by reductions in tracking precision. Allocation of this resource is subject to individual differences that depend partly on strategy but may also reflect differences in total capacity. Furthermore, people can flexibly allocate variable amount of tracking resources between targets. This resource appears to be largely hemifield specific and allocated in parallel to tracked objects.

Sensors are measuring a sort of signal attenuation from the present targets/sources. Multiple moving targets may die and be born at some point of the monitored period while the states of the sources, e.g. temperature of a fire source, CO/CO2 density of gas source, are also changing with time. In the case of targets tracking, radar signals sent out by sensors and later bounced back from the surface of the targets are measured at sensors, and the task is to find out the true position/velocity information hidden in the sensor measurements. While in the scenario where sources are present in the sensed field, the aforementioned signal attenuation is generally not available, so the task is to estimate the states of the corresponding sources and in the meanwhile recovering the unknown sensing observation matrix. Concretely, in this thesis a framework is put forth where norm-one regularized factorization is employed to decompose the sensor observation data covariance matrix into sparse factors whose support facilitates recovery of sensors that acquire informative measurements about the targets. This novel sensors-to-targets association scheme is integrated with pariticle filtering mechanisms to perform accurate tracking. Precisely, distributed optimization techniques are employed to associate targets with sensors, and Kalman/particle filtering is integrated to perform target tracking using only the sensors selected by the sparse decomposition scheme. Different from existing alternatives, the novel algorithm can efficiently track and associate targets with sensors even in noisy settings. As for the multi-source tracking scenario, two different sensing architectures are studied: i) A fusion-center based topology where sensors have a limited power budget; and ii) an ad hoc architecture where sensors collaborate with neighboring nodes enabling in-network processing. A novel source-to-sensor association scheme and tracking is introduced by enhancing the standard Kalman filtering minimization formulation with normone regularization terms. In the fusion-based topology a pertinent transmission power constraint is introduced, while coordinate descent techniques are employed to recover the unknown sparse observation matrix, select pertinent sensors and subsequently track the source states. In the ad hoc topology, the centralized minimization problem is written in a separable way and the alternating direction method of multipliers is utilized to construct an in-network algorithmic tracking and association framework. The problem of distributed tracking of multiple targets is tackled by exploiting sensor mobility and the presence of sparsity in the sensor data covariance matrix. Sparse matrix decomposition relying on norm-one/two regularization is integrated with a kinematic framework to identify informative sensors, associate them with the targets and enable them to follow closely the moving targets. Coordinate descent techniques are employed to determine in a distributed way the target-informative sensors, while the modified barrier method is employed to minimize proper error covariance matrices acquired by extended Kalman filtering. Different from existing approaches which force all sensors to move, here local updating recursive rules are obtained only for the target-informative sensors that can update their location and follow closely the corresponding targets while staying connected. Lastly, we extend out tracking scheme to tackle the problem of tracking multiple objects in a sequence of frames (video). The task of identifying objects is formulated as the process of factorizing a properly defined kernel covariance matrix into sparse factors. The support of these factors will point to the indices of the pixels that form each object. A coordinate descent approach is utilized to determine the sparse factors, and extract the object pixels. A centroid pixel is estimated for each object which is subsequently tracked via Kalman filtering. A novel interplay between the sparse kernel covariance factorization scheme along with Kalman filtering is proposed to enable joint object detection and tracking, while a divide and conquer strategy is put forth to reduce computational complexity and enable real-time tracking. Extensive numerical tests on both synthetic data and thermal video sequences demonstrate the effectiveness of the novel approach and superior tracking performance compared to existing alternatives.
