The temporal gamma-ray spectroscopy method takes advantage of the time-dependent decay of fission products. Employing Spearman's rank-order correlation coefficient and without prior knowledge of peak locations or their associated energies, temporal behavior patterns characteristic of radioactive decay were identified within the complex fission product gamma-ray spectra below 3 MeV of Pu-239 and U-235. Individual rho (rho [subscript s]) values and their respective differences ([delta] rho[subscript s]) were used as a part of feature selection to identify channels with significant attributes used as "fingerprints'' to create profiles for Pu-239 and U-235 which may be used for the identification of temporal behavior in an unknown sample. This method may be combined with additional machine learning techniques for future quantification of fissile material with the potential for similar accuracy and precision to previous temporal gamma-ray spectrometry methods.

The Los Alamos National Laboratory Nuclear Materials Signatures Program has implemented a graded 'conduct of operations' type approach for determining the unique nuclear, chemical, and physical signatures needed to identify the manufacturing process, intended use, and origin of interdicted nuclear material. In our approach an analysis flow path was developed for determining key signatures necessary for attributing unknown materials to a source. This analysis flow path included both destructive (i.e., alpha spectrometry, ICP-MS, ICP-AES, TIMS, particle size distribution, density and particle fractionation) and non-destructive (i.e., gamma-ray spectrometry, optical microscopy, SEM, XRD, and x-ray fluorescence) characterization techniques. Analytical techniques and results from three recent cases characterized by this analysis flow path along with an evaluation of the usefulness of this approach will be discussed in this paper.

Book excerpt: The timely detection of special nuclear material (SNM) transfers is an important monitoring objective in nuclear nonproliferation. Labeling sufficient volumes of radiation data for successful supervised machine learning can be too costly when manual analysis is employed. Therefore, this work is developing a machine learning model built on semi-supervised learning to utilize both labeled and unlabeled data and therefore alleviate the cost of labeling. As a preliminary experiment, radiation measurements collected with sodium iodide (NaI) detectors from the Multi-Informatics for Nuclear Operating Scenarios (MINOS) testbed at Oak Ridge National Laboratory (ORNL) are used. Anomalous measurements are identified using a method of statistical hypothesis testing. After background estimation, an energy dependent spectroscopic analysis is used to characterize an anomaly based on its radiation signatures in a noisy labeling heuristic. These noisily labeled spectra are used in training and testing classification models that estimate a binary label: SNM transfer or other anomalous measurement. Supervised logistic regression-trained only on limited labeled data-serves as a baseline to compare three semi-supervised machine learning models all trained on the same limited labeled data and a larger volume of unlabeled data: co-training, Label Propagation, and a Convolutional Neural Network (CNN). In each case, the semi-supervised models outperform logistic regression, suggesting unlabeled data can be valuable when training and demonstrating performative value in semi-supervised nonproliferation implementations. This work uses a self-supervised contrastive learning framework to efficiently extract information from unlabeled data. A contrastive model learns patterns by perturbing data instances using a set of label-invariant data augmentations, meaning augmented samples preserve labeling information present in an original measurement. A set of transformations are designed for gamma spectra, tailored for specific principles of radiation detection. MINOS measurements are augmented, and an encoder is contrastively trained to produce meaningful high-dimensional representations of spectra. A supervised classifier then uses these encoded representations to assign a label estimating whether a given transfer spectrum was of tracked nuclear material or not. Even a simple linear model built on these representations and trained on limited labeled data can achieve a balanced accuracy score of 80.30%. Several tools are employed for evaluating the efficacy of augmentations, representations, and classification models. Principal Component Analysis (PCA) is used to demonstrate that representations provide a richer feature space for detecting nuclear material transfers by embedding distributional information from unlabeled data. Integrated Gradients connect a classifier's decision boundary to spectral features, suggesting the framework learns relevant patterns in spectra that can be used for detecting transfers. When labeled data are scarce, this work suggests that training a supervised classifier should be prioritized over semi-supervised (compared to self-supervised) contrastive learning an encoder to maximize detection accuracy. Hyperparameter optimization was conducted, finding a locally optimum maximum cross-validated balanced accuracy score. Overall, a methodology has been established for using semi-supervision to accurately classify SNM transfers without the prohibitive cost of labeling.

Other potential applications include determination of MOX fuel composition, characterization of nuclear waste packages, and challenges in homeland security and arms control verification. Experimental measurements were performed to evaluate fission fragment yields, to test methods for determining isotopic fractions, and to benchmark the modeling code package. Experimental measurement campaigns were carried out at the IAC using a photo-neutron source and at OSU using a thermal neutron beam from the TRIGA reactor to characterize the emission of high-energy delayed gamma rays from 235U, 239Pu, and 241Pu targets following neutron induced fission. Data were collected for pure and combined targets for several irradiation/spectroscopy cycle times ranging from 10/10 seconds to 15/30 minutes. The delayed gamma-ray signature of 241Pu, a significant fissile constituent in spent fuel, was measured and compared to 239Pu. The 241Pu/239Pu ratios varied between 0.5 and 1.2 for ten prominent lines in the 2700-3600 keV energy range. Such significant differences in relative peak intensities make it possible to determine relative fractions of these isotopes in a mixed sample. A method for determining fission product yields by fitting the energy and time dependence of the delayed gamma-ray emission was developed and demonstrated on a limited 235U data set. De-convolution methods for determining fissile fractions were developed and tested on the experimental data. The use of high count-rate LaBr3 detectors was investigated as a potential alternative to HPGe detectors. Modeling capabilities were added to an existing framework and codes were adapted as needed for analyzing experiments and assessing application-specific assay concepts. A de-convolution analysis of the delayed gamma-ray response spectra modeled for spent fuel assemblies was performed using the same method that was applied to the experimental spectra.

Book excerpt: This dissertation addresses the need for new non-destructive assay instruments capable of quantifying the fissile isotopic composition of spent nuclear fuel and of independently verifying the declared amounts of special nuclear materials at various stages of the nuclear fuel cycle. High-energy delayed gamma-ray spectroscopy can provide the ability to directly assay fissile and fertile isotopes in the highly radioactive environment of the spent fuel assemblies and to achieve the safeguards goal of measuring nuclear material inventories for spent fuel handling, interim storage, reprocessing facilities, and final disposal and repository sites. The delayed gamma-ray assay concept is investigated within this context with the objective of assessing whether the delayed gamma-ray assay instrument can provide sufficient sensitivity, isotope specificity and accuracy as required in nuclear material safeguards applications. Preliminary system design analysis indicates that the delayed gamma-ray response is affected by multiple parameters: type and intensity of the interrogating source, the configuration of the interrogation setup, the time pattern of the interrogation, and the resolution and count rate limit of the gamma-ray detection system. In order to handle the variety of factors associated with the delayed gamma-ray assay of spent nuclear fuel, a high-fidelity response modeling technique is introduced. The new algorithm seamlessly combines transport calculations with analytical decay/depletion, and discrete gamma-ray source reconstruction codes. Its performance was benchmarked in the dedicated experimental campaign involving accelerator-driven photo-neutron sources and samples containing fissile and fertile isotopes. Analytical estimations of the intensity of the delayed gamma-ray response and the passive background rate are utilized to develop a concept of the non-destructive instrument for the assay of spent nuclear fuel. The modeling technique is then applied to more detailed parametric study. These simulations included extensive spent fuel inventories, and accounted for realistic assay configurations and instrumentation. The results of this preliminary analysis indicate that the delayed gamma-ray assay of spent nuclear fuel assemblies can be performed with available neutron generator and detection technology. The sensitivity of the delayed gamma-ray spectra to the actinide content of the spent nuclear fuel is investigated. The simplest analysis of the delayed gamma-ray response is based on the analysis of integrated count rates and peak ratios. More powerful analytical and numerical methods are likely needed for determining the relative concentrations of fissile and fertile isotopes in samples with complex compositions.
